Abstract

Variance reduction improves the convergence rate of stochastic non-convex optimization under the average smoothness condition. Existing adaptive variance reduction methods are especially designed for average smoothness and do not adapt to standard smoothness. In this paper, we study how one algorithm can adapt to these two settings and the noiseless setting without knowing the smoothness constants or the variance bound. Given the gradient budget TT, we develop a two-phase method. The first phase compares two independent gradients and switches to normalized momentum when their difference exceeds a threshold. This phase provides both a candidate with standard smooth and noiseless guarantees and also ensures a bounded expected function gap for the second variance reduction phase. The resulting rates are O(T−1/3)O(T^{-1/3}) under average smoothness, O(T−1/4)O(T^{-1/4}) under standard smoothness, and O(T−1/2)O(T^{-1/2}) without noise. When TT is unknown, we propose a method with two paths that attain the corresponding rates with logarithmic factors in the stochastic settings. Here, we use a variance reduction path to deal with average smoothness and employ the AdaGrad-Norm for standard smoothness and noiseless setting. Neither method restarts from the initial point or requires a growing number of oracle calls in each round.

Beyond Bounded Variance: Variance-Reduced Normalized Methods for Nonconvex Optimization under Blum-Gladyshev Noise

We study nonconvex stochastic optimization under the Blum-Gladyshev (BG\mathsf{BG}-0) noise model, where the stochastic gradient variance grows quadratically with the distance from the initialization. We consider this problem under both standard smoothness and the symmetric generalized-smoothness framework, which captures objectives whose local curvature can scale with the gradient norm. We prove that normalized stochastic gradient descent with momentum, using only one stochastic gradient per iteration, converges under BG\mathsf{BG}-0 noise with oracle complexity O(ε−6)O(\varepsilon^{-6}). This rate holds both for standard smoothness and for αα-symmetric generalized smoothness, showing that generalized smoothness is rate-neutral for normalized momentum in this setting. We then study a variance-reduced normalized STORM method. Under mean-square smoothness and sharp initialization, the method achieves the minimax optimal O(ε−4)O(\varepsilon^{-4}) complexity, matching the lower bound. Under expected αα-symmetric generalized smoothness, the STORM recursion couples gradient-dependent smoothness with distance-dependent noise, leading to complexity O(ε−(4+α))O(\varepsilon^{-(4+α)}) for α∈(0,1)α\in(0,1) and O(ε−5)O(\varepsilon^{-5}) for α=1α=1. When the distance-growth parameter in the noise model vanishes, our guarantees recover the standard bounded-variance rates: O(ε−4)O(\varepsilon^{-4}) for momentum, O(ε−3)O(\varepsilon^{-3}) for variance reduction, and O(ε−2)O(\varepsilon^{-2}) in the deterministic case. To our knowledge, these are the first convergence guarantees for normalized methods in non-convex stochastic optimization under BG\mathsf{BG}-0 noise without bounded domains, increasing batch sizes, or explicit anchoring, covering both standard and generalized smoothness regimes.

A Tight Lower Bound for Smooth Nonconvex Stochastic Optimization with Bounded Gradient Noise

We prove a sharp lower bound for smooth nonconvex stochastic optimization with uniformly bounded gradient noise. In the K=1K=1 fresh-sample model, every randomized adaptive algorithm requires Ω(ΔLε2+ΔLσ2ε4)Ω\left( \frac{ΔL}{ε^2} + \frac{ΔLσ^2}{ε^4} \right) queries to find a point with expected gradient norm at most εε. This matches the standard upper bound and, to the best of our knowledge, resolves the question raised by [Arjevani et al. 2023] of whether almost-surely bounded oracle error permits a better rate than bounded variance. The proof was independently generated with GPT-5.6 Sol in Codex's Ultra mode during a two-hour session. The human author supplied the prompt and was responsible only forchecking the proof and revising and polishing the manuscript.

Revisiting AdaGrad in Stochastic Convex Optimization: Last Iterates, High Probability, and Lower Bounds

AdaGrad and AdaGrad-Norm are widely used adaptive methods, but their precise behavior in stochastic convex optimization remains less understood. We first show that AdaGrad-Norm and AdaGrad do not admit any universal \textbf{last-iterate} rate, even under sub-Gaussian noise and bounded iterates. We then prove that bounded variance alone is too weak: even with bounded iterates, it cannot yield \textbf{high-probability average-iterate} rates, and without bounded iterates it may not even guarantee convergence in expectation. Besides, we construct tight Ω(log⁡T/T)Ω(\log T/\sqrt T) lower bounds for both AdaGrad-Norm and AdaGrad under sub-Gaussian noise, showing that log⁡T\log T in existing average-iterate upper bounds is unavoidable. Finally, we show that this log⁡T\log T loss disappears once bounded-iterate condition is imposed: under a general ABC condition, both methods achieve rates O(1/T){O}(1/\sqrt{T}).
