The minimal width of neural networks and immersions of real projective space

Authors: BaoZhi Chu, Ben Weinkove

Abstract

We investigate the minimal width of deep neural networks that can approximate all continuous functions from Rn\mathbb{R}^n to Rm\mathbb{R}^m in the topology of uniform convergence on compact subsets. We show that whenever the real projective space RPn−1\mathbb{RP}^{n-1} admits a smooth immersion into Rn\mathbb{R}^n, the minimal width is at least n+min⁡{n,m}n+\min\{n,m\}, assuming that the activation function is continuous and monotone. As a consequence, the minimal width of ReLU networks is n+mn+m whenever nn is equal to 2, 3, 4, 7 or 8 and 1≤m≤n1\le m \le n, extending results of Hanin-Sellke and Hwang. This suggests an intriguing connection between the approximation theory of neural networks and differential topology.

Approximation of Analytic Functions by ReLU Neural Networks with Adjustable Depth and Width

In contrast to most studies on neural network approximation theory that characterize results through a single parameter, such as the total number of network parameters, \cite{shen2020deep} pioneered the characterization of approximation rates as a joint function of the width parameter NN and the depth parameter LL, thereby granting greater architectural flexibility. Existing works using the (N,L)(N,L)-characterization focus on function classes with finite smoothness ss, establishing a typical approximation rate of O(N−2s/dL−2s/d)\mathcal{O}\left(N^{-2s/d}L^{-2s/d}\right) with dd denoting the input dimension, which indicates that network depth and width play symmetric roles for these classes. In contrast, this paper establishes upper bounds for the approximation of analytic functions, which possess infinite smoothness, via ReLU networks under the (N,L)(N,L)-characterization. Specifically, we derive approximation rates of O(N−CLτ)\mathcal{O}\left(N^{-C L^τ}\right), where C>0C>0 is some constant and τ>0τ>0 is a parameter influenced by the relation between LL and NN. In particular, τ=1τ=1 if NN scales roughly as LdL^d. Our findings reveal that depth plays a more critical role than width in the context of analytic function approximation. The main technical difficulty of obtaining such upper bounds lies in the trade-off between the smoothness parameters and the approximation accuracy. To overcome this difficulty, we employ refined constructions of several ReLU networks to approximate power functions, multivariate multiplication, and polynomials, which may be of independent interest.

The Geometry of Limits in ReLU Function Spaces

We study the geometry and closure of spaces of functions realized by ReLU neural networks of fixed architecture. We first establish a general result about limits of continuous piecewise-linear (CPWL) functions: the minimum number of convex sets on which a function is affine is lower semicontinuous under pointwise convergence. The proof uses a connection to hypergraph coloring and a compactness principle, and yields quantitative bounds on the polyhedral complexity of continuous limits. We then characterize the functions realizable by shallow ReLU networks with vector-valued outputs, extending a known scalar-valued characterization. Using this and the geometry of limiting hyperplane arrangements, we prove that fixed-width shallow scalar ReLU realization spaces are closed in the weighted supremum norm on the whole input space. In contrast, we construct an explicit sequence of networks with architecture (2,3,2∣1)(2,3,2\mid1) whose limit is not realizable by that architecture. Non-closedness holds both globally in weighted supremum norm and under uniform convergence on compact sets with nonempty interior, disproving a conjecture of Petersen, Raslan, and Voigtlaender. Finally, we show that non-closedness for a fixed scalar-output ReLU architecture necessarily involves a blow-up residue, in which diverging output coefficients amplify an emerging linear dependence among hidden features. Together, these results provide geometric and functional-analytic tools for studying the boundaries and degenerations of ReLU realization spaces.

Deep ReLU Networks Can Fail the Best Approximation Property for Continuous Target Functions

We construct a continuous function on [−1,1]2[-1,1]^2 for which the infimum of the L2L^2-approximation error over the class of ReLU networks with two hidden layers and architecture (2,2,1,1)(2,2,1,1) is not attained. This counterexample shows that deep ReLU networks do not satisfy the best approximation property in general, even for continuous target functions. Our findings contrast with existing results for shallow neural networks, where ReLU is one of the few activation functions that guarantee the existence of global minima in typical regression tasks. The proof is based on the fact that the breaklines for neurons in the second hidden layer can bend, which breaks the symmetry arguments used in the one-hidden-layer case.
