Abstract

We study eigenpair estimation for the tensorized, density-weighted Laplace--Beltrami operator from nn independent data points sampled from a multi-manifold mixture distribution where manifolds may intersect. Let dd denote the largest intrinsic dimension of the manifold components and s≥2s\geq2 the smoothness of the sampling densities. For simple, nontrivial eigenpairs, we establish the minimax rate n−s/(d+2s)n^{-s/(d+2s)} for approximating the eigenvalue and eigenfunction of the tensorized Laplace--Beltrami operator, and show that a continuum plug-in estimator based on kernel density estimation attains the same rate when the supporting manifolds are known. We further analyze a manifold-agnostic graph Laplacian estimator and prove that its eigenpairs converge to those of the tensorized Laplace--Beltrami operator at rate n−1/(2.5d−1)n^{-1/(2.5d-1)}, up to logarithmic factors, improving upon previously known spectral convergence rates for multi-manifold learning. Numerical experiments on synthetic multi-manifold data corroborate the rates guaranteed by our theorems. These results characterize the information-theoretic difficulty of multi-manifold spectral estimation and quantify the additional cost of learning without oracle component information.

Complex Interpolation of Matrices with an application to Multi-Manifold Learning

Given two symmetric positive-definite matrices A,B∈Rn×nA, B \in \mathbb{R}^{n \times n}, we study the spectral properties of the interpolation A1−xBxA^{1-x} B^x for 0≤x≤10 \leq x \leq 1. The presence of `common structures' in AA and BB, eigenvectors pointing in a similar direction, can be investigated using this interpolation perspective. Generically, exact log-linearity of the operator norm ∥A1−xBx∥\|A^{1-x} B^x\| is equivalent to the existence of a shared eigenvector in the original matrices; stability bounds show that approximate log-linearity forces principal singular vectors to align with leading eigenvectors of both matrices. These results give rise to and provide theoretical justification for a multi-manifold learning framework that identifies common and distinct latent structures in multiview data.

Learning manifold diffusion semigroups from graph transition matrices

We consider graph diffusion processes constructed from finite i.i.d. samples drawn from an unknown manifold embedded in ambient Euclidean space, where the graph affinity is defined by an ambient Gaussian kernel matrix. We show that the manifold heat semigroup Qt=etΔQ_t = e^{tΔ} can be approximated directly by iterating the graph transition matrix PP, under only low regularity assumptions on the test function ff, including the case f∈L∞f \in L^\infty. We bound ∥Pnf−Qtf∥\| P^n f - Q_t f \| in ∞\infty-norm, with the operator application to ff properly defined, and we recover the classical graph-Laplacian pointwise rate O(N−2/(d+6))O(N^{-2/(d+6)}) up to logarithmic factors, for diffusion times tt up to O(1)O(1) and longer. The rate holds for in-sample error as well as out-of-sample generalization, where the estimator of QtfQ_t f at a new point is defined via kernel convolution. To handle non-uniform sampling densities on the manifold, we introduce a right-normalization of the graph transition matrix; under the assumption that the sampling density pp is C3C^3 and bounded away from zero, the same convergence rates hold. We numerically demonstrate the performance of the proposed estimator on simulated data.

Multi-kernel spectral clustering: Entrywise eigenvector perturbation bounds and exact recovery

Kernel spectral clustering with a single bandwidth can be inadequate for data exhibiting multiple characteristic pairwise-distance scales, a problem particularly prevalent in the high-dimensional regime. We address this issue through a multi-kernel formulation that aggregates kernels with different bandwidths. The bandwidths are selected as prescribed empirical quantiles of the pairwise squared distances, thereby capturing the relevant distance scales without requiring prior population-scale information. We develop a rigorous theoretical analysis of the resulting method under a general high-dimensional, multi-scale mixture model with heterogeneous cluster centers and covariance geometries. We construct a blockwise constant, low-rank informative approximation to the empirical multi-kernel matrix and establish row-wise ℓ2,∞\ell_{2,\infty} perturbation bounds for its leading spectral components, as well as for the associated normalized Laplacian matrix. These bounds yield observation-level control of the spectral embedding, which is more informative than conventional global eigenspace perturbation estimates. Under suitable eigen-gap and cluster-separation conditions, we show that approximate KK-means applied to the multi-kernel spectral embedding achieves exact recovery with high probability.
