Abstract

We study regret minimization for time-homogeneous episodic tabular reinforcement learning with SS states and AA actions under non-interactive εε-local differential privacy (LDP). In each episode k∈[K]k \in [K], the decision-maker sends a policy to a user, the user executes the policy for HH steps, and sends an εε-locally differentially private message back to the decision-maker. When H=1H=1, the problem reduces to an LDP contextual bandit with SS contexts, AA arms and horizon KK. We prove that the minimax regret is min⁡(K,max⁡(S,exp⁡(ε)+1)SAK(exp⁡(ε)+1)exp⁡(ε)−1)\min\bigg(K, \frac{ \sqrt{\max( S, \exp(ε) + 1) S A K (\exp(ε) + 1)}}{\exp(ε) - 1}\bigg), up to constants and a log⁡(A)\sqrt{\log(A)} factor. The upper bound is achieved by an adaptation of EXP3 and a unary encoding mechanism. When H>1H > 1, and for small εε, we show a lower bound in Ω(HSAKε)Ω(HS\frac{\sqrt{A K}}ε) and an upper bound in O~(H2S2AKε)\tilde{O}(H^2 S^2 \frac{\sqrt{ AK}}ε). The upper bound is achieved by an algorithm based on UCBVI and a unary encoding mechanism. For small εε, these bounds improve the previously known lower bound by a factor S\sqrt{S} and the previously known upper bound by a factor of HAH \sqrt{A}.

Towards Differentially Private Reinforcement Learning with General Function Approximation

We present the first theoretical guarantees for differentially private online reinforcement learning (RL) with general function approximation, extending beyond prior work restricted to tabular and linear settings. Our approach combines a batched policy update scheme with the exponential mechanism, together with a novel regret analysis. We show that, even under general function approximation, the regret in the model-free setting under differential privacy matches the state of the art for the linear case, scaling as O~(K3/5)\widetilde{O}(K^{3/5}), where KK denotes the number of episodes. As an important by-product, we also establish the first regret bound for online RL with batch update that depends on the standard complexity measure of coverability, complementing existing results based on a newly introduced Eluder-Condition class. In addition, we uncover fundamental gaps in recent results for private RL with linear function approximation, thereby clarifying its landscape.

Differential Privacy in the Extensive-Form Bandit Problem

We consider the extensive-form bandit problem, where on each trial the learner (a user coordinated by a server) plays an extensive-form game against an oblivious adversary, observing the information sets it finds itself in as well as the resulting payoff/loss. We give an algorithm for this problem that satisfies εε-local differential privacy and attains a regret of O~(Aln⁡(S)T/ε)\tilde{O}(\sqrt{A\ln(S)T}/ε), where AA is the total number of actions that the learner can possibly take, SS is the number of the learner's possible reduced strategies, and TT is the number of trials. On each trial, the time complexity of our algorithm is, up to a factor logarithmic in the maximum number of actions at an infoset, equal to the time required for the server to transmit the reduced strategy to the user. We note that local differential privacy is the strongest version of differential privacy and, to the best of our knowledge, this is the first work to study differential privacy of any form in the extensive-form bandit problem.

Closing the Log Gap: Minimax-Optimal Regret for Episodic RL

In this paper, we study the regret minimization problem in episodic tabular MDPs. Our algorithm achieves the first expected regret bound scaling as H3SAK\sqrt{H^3 S A K} for sufficiently large KK, where HH is the episode length, KK is the number of episodes, and SS and AA are the numbers of states and actions, respectively. Our method is the first to match the minimax lower bound without extra polylog factors. We introduce a variant of UCBVI which does not maintain strictly optimistic estimates, and uses MOSS-style exploration bonuses whose logarithmic terms adapt to both visit counts and estimated variances. A key challenge is controlling the propagation of errors caused by under-optimism, which we accomplish in an occupancy-weighted way, avoiding logarithmic overhead that would be incurred by uniform-over-rows concentration. Our analysis develops time-uniform and variance-aware concentration bounds that may be of independent interest. As a corollary we also develop an algorithm for (ε,δ)(\varepsilon, δ)-PAC best-policy identification, which is the first to match the Ω(H3SAlog⁡(1δ)ε−2)Ω\big(H^3 SA\log(\frac{1}δ)\varepsilon^{-2}\big) minimax lower bound up to constants in some regimes.
